Playback starts on loudspeaker of device when I put my AirPods back in the case

As the title says: This seems to happen specifically when I put the AirPods in the case, not just take them out of my ears. This can be after having playback stopped for a fair amount of time or if I’ve taken my AirPods out and not put them in the case straight away.

How can I stop this from happening? It’s startled me with unexpected music and had me diving for my phone to stop an audiobook so my partner doesn’t get any spoilers!
